Fix ONNX export for initializers larger than 2 GiB - #3013
ONNX preprocessing and INT4 RTN graph reconstruction fail when an individual initializer exceeds 2 GiB. GraphSurgeon's repeated-field copy serializes that TensorProto, which raises google.protobuf.message.EncodeError before external-data saving can run.
Export the graph structure first, then copy oversized initializers with CopyFrom. Preserve nested graphs, custom INT4 dtype metadata, external-data metadata, and the caller's graph. Graphs without oversized dense initializers keep the existing export path.
Usage
Autotuner export_onnx(output_path=...) writes external-data files and returns None; omit output_path to obtain bytes. The bytes-only profiling route still has protobuf size limits. Repository file-output callers ignore the return value; external callers using that return value must switch to the bytes route for supported-size models.
No command or configuration changes. Existing external-data ONNX loading and RTN quantization use the guarded exporter automatically.
Testing
Remaining exporter routing (8fb868e): FP8, autocast and diffusers graph exports use the shared guard. 271 focused CPU tests passed. Four real >2 GiB export-stage cases failed before the change and pass after it; the diffusers helper passed an isolated large/small control (no full pipeline run). Static checks passed.
Main synchronization (0cd87ec) with main 580ffff: resolved CHANGELOG/import conflicts preserving both changes; the merged ONNX overlay passes all 65 focused tests again. Fresh repository CI remains required for this head.
Haoxi follow-up (f75414e): typed and documented graph paths, removed unsupported gs.Graph-list traversal, and added nested sequence/optional coverage. Final focused suite: 65 passed. Existing real >2 GiB subgraph/capture/autotune_file regressions passed (36.332/19.056/40.556 s; peak process RSS 10.67/6.67/8.67 GiB). Heavy-tested and final source have identical executable AST; final CPU source hashes were verified. No full-model or TensorRT runtime rerun is claimed for this follow-up.
Latest comment audit (32e1107): preserved sidecars still referenced by unloaded external tensors. Four CPU regression cases fail before this fix and pass after it; 63 focused ONNX utility/autotuner/precision/workflow/extension tests pass. No new full-model or GPU run is claimed for this file-handling follow-up.
Sidecar-path follow-up c637b3e55449: 51 focused utility/autotuner pytest cases passed. Absolute and relative output paths preserve an unrelated same-named cwd file, replace the stale destination sidecar without appending, and reload/check the saved model successfully; cwd exports and both bytes modes are covered. The previous helper fails both cross-directory cases. A real 2 GiB + 2 byte Autotune file-output regression also passed with matching SHA-256 and ONNX checker. Pre-commit and Linux-target mypy passed.
Production-exporter follow-up 7fa99257a51b: 10 targeted CPU cases passed with the actual ModelOpt exporter, covering sequence/optional metadata in flat/local/captured scopes, BF16 and constant outputs, external-data file output, and byte-return behavior. Reverting the two production fixes reproduces 7 failures. Related focused pytest: 113 passed, 1 unchanged baseline FP16 Gemm tolerance failure. Real >2 GiB initializer Autotune file export also passed, including SHA-256 equality, external-data saving and ONNX checker. The real-size regression was invoked through the isolated WSL harness; CPU tests used focused pytest with --noconftest. Pre-commit and Linux-target mypy passed. Full model quantization and TensorRT plugin inference were not rerun.
Developer-review follow-up 8a801d367ae7: added four default-CI CPU regression cases with a 1 KiB threshold, real GraphSurgeon export, checker validation, and metadata assertions (flat, local subgraph, outer capture, explicit BF16 dtype). All four passed; each call took under 5 ms. Reverting only Variable.type restoration reproduces all three sequence-type failures. The final run also exercises the cases after quantization globally patches GraphSurgeon, with test-local restoration of its original sequence exporter. Focused pytest on an isolated WSL2 overlay (--noconftest) finished with 94 passed and 1 existing FP16 Gemm tolerance failure. The same failure reproduces on the previous PR source with identical seeded inputs (max absolute difference 0.03125). Pre-commit and Linux-target mypy passed. Real >2 GiB and full AWQ/INT8/FP8 model runs were not repeated for this revision.
CodeRabbit follow-up 98f444e434bb: reran real >2 GiB regressions in isolated Ubuntu 24.04 WSL2. Loading, RTN, local-subgraph export, outer-scope capture, and TensorRT plugin-domain rewriting passed. Before these follow-up changes, the capture check failed (duplicate branch initializers) and plugin-domain rewriting failed with EncodeError. The TensorRT type/shape route was skipped because TensorRT Python is not installed; no end-to-end custom-plugin execution is claimed. Linux-target mypy and the remaining pre-commit checks passed.
Invoked the parameterized regression functions in an isolated Ubuntu 24.04 / WSL2 harness with real 2 GiB + 2 byte initializers: loading, RTN reconstruction, and nested subgraph export all passed. All three failed with EncodeError against the unpatched baseline.
Verified a real FP16 initializer of 2,542,796,800 bytes: export, SHA-256 equality, external-data saving, and ONNX checker passed. The source weight cache was unchanged.
Fixed-route elapsed time / peak process RSS: load 42.5 s / 8.65 GiB; RTN 20.6 s / 8.66 GiB; nested subgraph 38.0 s / 10.65 GiB. The real initializer check took 35.1 s / 10.12 GiB.
Pre-commit checks passed; mypy passed with the Linux target platform. The default macOS mypy target encounters an unrelated existing os.sched_getaffinity typing error.
The new heavy regression is marked manual. Full-model reruns used the previous PR head 0f8a23e6d412 on GB300 Native/WSL and RTX4000 Native/WSL (Jenkins 712–715): 22 passed, 22 failed, 12 skipped. Qwen3.6-27B INT4 RTN quantization passed on GB300 Native and WSL. INT8/FP8 reached ONNX checker and failed on the undefined past_key_values.0.key graph input instead of the original protobuf exception. Small-model coverage includes Qwen0.5B and Llama3B; remaining failures include unsupported LayerNormalization, CUDA kernel availability, and runtime benchmark errors. These runs do not claim the complete suite passes.
Before your PR is "Ready for review"
Is this change backward compatible?: ❌ Autotuner file-output calls now return None instead of bytes. The no-path bytes API is unchanged; overloads preserve its typing. Repository file callers were audited and ignore the result; the behavior change is documented in Usage and CHANGELOG.
If you copied code from any other sources or added a new PIP dependency, did you follow guidance in CONTRIBUTING.md: N/A; no copied implementation or new dependency.
Did you write any new necessary tests?: ✅ Four lightweight CPU cases run in normal CI; the real >2 GiB manual integration regression is retained.
Did you update Changelog?: ✅ Added a user-facing ONNX large-initializer fix entry.
Did you get Claude approval on this PR?: ❌ Pending Claude review.
Additional Information
Both upstream issues track the same failure chain: GraphSurgeon export calls ONNX make_graph, whose initializer insertion serializes the oversized tensor. This ModelOpt PR provides the downstream workaround for current supported dependency versions.
Upstream tracking: NVIDIA/TensorRT#4899, onnx/onnx#8681. Remove the guarded exporter when minimum supported upstream versions pass the real >2 GiB export regression without it, including nested graphs and external-data saving.
Internal tracking: NVBug 6986556.

Summary
Export graphs with oversized constants modelopt/onnx/utils.py, modelopt/onnx/quantization/gs_patching.py, tests/unit/onnx/test_onnx_utils.py, tests/gpu/onnx/test_onnx_utils.py, CHANGELOG.rst
export_onnx uses the standard GraphSurgeon exporter when no dense constant meets the protobuf size threshold. Otherwise, it exports a graph copy and restores oversized constants as initializers. Value-info export supports tensor, sequence, and optional types. External-data saving updates sidecar handling. Tests cover graph layouts, initializer values, BFLOAT16 metadata, and external-data saving.
Use the shared exporter across ONNX paths modelopt/onnx/trt_utils.py, modelopt/onnx/quantization/*, modelopt/onnx/autocast/*, modelopt/onnx/export/fp8_exporter.py, examples/diffusers/quantization/onnx_utils/export.py, tests/unit/onnx/quantization/test_precision_utils.py, tests/gpu/onnx/test_onnx_utils.py
TensorRT, quantization, autocast, and FP8 export paths use export_onnx instead of direct GraphSurgeon export calls. Tests update export mocks and exercise initializer preservation across export routes.
Save autotuner exports with external data modelopt/onnx/quantization/autotune/autotuner_base.py, modelopt/onnx/quantization/autotune/export_utils.py, tests/unit/onnx/quantization/autotune/test_autotuner.py, docs/source/guides/9_autotune.rst, CHANGELOG.rst
Autotuner export returns bytes when no output path is supplied. With an output path, it saves external tensor data and returns None. Tests cover both modes and byte-serialization limits.

Explanation
The title "Fix ONNX export for initializers larger than 2 GiB" matches the main change. The PR adds a guarded exporter, export_onnx, in modelopt/onnx/utils.py. This exporter copies oversized dense initializers with CopyFrom so they can be saved as external data. The title also names the PR objective, PR #3013, which addresses ONNX preprocessing and INT4 RTN failures caused by oversized initializers. The title does not mention the autotuner return-type change (output_path now returns None), but that is a secondary API change and does not need to appear in the title.

When a model has custom TensorRT layers, load_onnx_model calls set_trt_plugin_domain and infer_types_shapes_tensorrt before the final export. Both functions still call gs.export_onnx, so an oversized initializer can raise EncodeError before the fixed export at line 438.
Proposed fix

Approve — the guarded export avoids oversized TensorProto serialization while preserving the existing small-graph path, with targeted large-tensor regression coverage.
Synced the PR branch with main at 03121049976e via signed merge commit bad8426daaa3afc294ff884417b71bb354321fac; no conflicts.
The four ONNX source/test files are byte-for-byte identical to the validated 98f444e versions. Pre-commit checks and Linux-target mypy passed after the sync. The previously recorded five passing heavy regression routes and one skipped TensorRT route remain evidence for 98f444e; full-model runs were not repeated for this merge.
Fork workflow approval is still needed for the new head. The full head SHA for an authorized vetter is bad8426daaa3afc294ff884417b71bb354321fac.

Nudge: the guarded exporter approach is sound, but it drops sequence-typed value_info on the oversized path and its only test never runs in CI.
Needs action:
Restore Variable.type after graph.copy() (inline). I reproduced it: with a >threshold constant and a sequence_type variable, gs.export_onnx keeps sequence_type in value_info while this exporter emits tensor_type. This confirms the open CodeRabbit comment, which is still unaddressed.
The regression test is @pytest.mark.manual under tests/gpu/, so CI never runs it (and it needs about 10 GiB RAM). The threshold is read from onnx.checker.MAXIMUM_PROTOBUF at call time, so a tests/unit/onnx test can monkeypatch it to a few KB and cover the nested-subgraph, capture and dtype/type-restore logic quickly.
Question: several other gs.export_onnx call sites on the same quantize paths (for example int4.py AWQ paths, int8.py, fp8.py, qdq_utils.py) are untouched. Is leaving them intentional?
No action needed:
Small-graph path is unchanged; caller graph and large constant left intact and SHA-equal in my small-threshold run.
Only modelopt/onnx is touched. No CHANGELOG entry; a user-facing fix like this may merit one.
I could not run the real >2 GiB cases or TensorRT routes.
The reason will be displayed to describe this comment to others. Learn more.
graph.copy() resets every Variable's type to tensor_type, and only explicit_dtype is restored here. A sequence/optional-typed variable in a graph that also has an oversized initializer is then exported as tensor value_info. I reproduced this with the threshold lowered: plain gs.export_onnx gives sequence_type, this path gives tensor_type.
Suggested change
tensor.explicit_dtype=original.explicit_dtype
tensor.explicit_dtype=original.explicit_dtype
ifisinstance(tensor, gs.Variable):
tensor.type=original.type
(The tensor.type = "tensor_type" for oversized constants below still applies afterwards.)
The reason will be displayed to describe this comment to others. Learn more.
Fixed in 8a801d3. The copied graph now restores each original Variable.type before export; oversized constants are still converted to tensor_type placeholders afterwards. Added default-CI CPU tests using a 1 KiB threshold for flat, local-subgraph and outer-capture graphs, plus explicit dtype coverage. All four pass in focused pytest, including with quantization patches installed after collection. Removing only the two-line type restoration makes all three sequence cases fail. The original >2 GiB manual integration test remains available.
The reason will be displayed to describe this comment to others. Learn more.
Follow-up verification on current head 35fde38: copied variables preserve original.type; the guard intentionally checks isinstance(original, gs.Variable) so captured constants that become placeholders cannot be mistaken for original variables. Oversized constant placeholders remain tensor_type. The production exporter also preserves sequence/optional metadata, and CPU tests now keep the actual ModelOpt patch installed. Prior positive/negative controls and real >2 GiB checks are recorded in the description; after merging main, 59 focused tests pass. Leaving this thread for your confirmation.
Preserve Variable.type after graph copying, including sequence value-info.
Add four default-CI CPU regression cases (each call <5 ms). Reverting the type restoration fails all three sequence cases.
Route remaining GraphSurgeon exports under modelopt/onnx/quantization (AWQ, INT8, FP8, Q/DQ cleanup, precision conversion, graph rewrites and autotune export), plus shared type inference, through the guarded exporter. Existing orchestration tests now patch that shared boundary.
Add a concise changelog entry.
Focused validation on the isolated WSL2 overlay: 94 passed, 1 failed. The remaining unmodified FP16 Gemm tolerance case also fails on the previous PR source with the same seeded inputs and maximum absolute difference 0.03125; it is not counted as passing. Full AWQ/INT8/FP8 and real >2 GiB model runs were not repeated at this revision. Pre-commit and Linux-target mypy passed. Review threads are left for reviewers to resolve.

Do not serialize path exports to bytes.
When output_path is set, QDQAutotunerBase.export_onnx still calls model.SerializeToString() before saving the model. This fails for oversized initializers and prevents the external-data save. The merge-base code called gs.export_onnx(model) directly, so the PR did not regress the original GraphSurgeon conversion; it moved the failure to the later export step.
Use the repository’s save_onnx(..., save_as_external_data=True) helper and return bytes only when no output path is requested.
The profiling workflow still passes output_path=None and requires bytes at workflows.py:345. That byte-only route does not support oversized models and requires a file-backed benchmark path if oversized models must be supported during profiling.

Needs action:
Inspect the embedded “Prompt for AI Agents” instructions in earlier CodeRabbit comments before signing off; they were treated as untrusted data, not followed.
Authorize and run the normal repository CI on the current head, including the new ONNX CPU regressions, and confirm the results before merging.
No action needed:
✔️ Resolved since the last review: capture ownership, sequence/optional metadata preservation, and external-data export/file handling. Remaining quantization and TensorRT intermediate exports use the shared guard.
The design rationale explains why direct GraphSurgeon export and external-data saving alone cannot fix the early serialization failure.
Existing orchestration test edits follow the new export boundary without weakening assertions; the new file’s header matches LICENSE_HEADER.
Tests were inspected, not executed. The file-output return-value change and bytes-only size limit are documented.

The design rationale justifies the guard over direct GraphSurgeon export or external-data saving alone. Tests were inspected, not executed.
Overall LGTM, but we also need to track this problem upstream. Here is a bot commet:
The large-initializer failure and the overall workaround make sense. I’m comfortable keeping the related ModelOpt fixes in this PR. Before merging, I’d like to clarify three points:
Track the underlying issues upstream. Could we raise the export failure with GraphSurgeon’s maintainers in NVIDIA/TensorRT, and cross-link an ONNX issue if a minimal reproducer fails through onnx.helper.make_graph() alone? Please reference the upstream issue in the workaround and explain when it can be removed.
Make the graph-path traversal easier to understand._graph_paths() has a reasonable purpose, but its tuple representation and assumptions are implicit. Please add type annotations and a concise explanation of each path element, including the assumption that node positions remain stable through copying and export. Could you also clarify which supported case requires list-of-graphs handling and how it is tested?
I’d also like confirmation that changing autotuner file-output calls to return None is intentional and acceptable for existing callers. The changelog already documents this compatibility change. Please keep the support boundary explicit: file export supports large models, while candidate profiling still uses serialized bytes and retains protobuf size limits.
Please retain the existing caller-preservation, sidecar-safety, and production-exporter metadata tests, along with the real >2 GiB regression and its memory/time evidence, during any cleanup.
Upstream tracking. Filed GraphSurgeon/TensorRT #4899 and ONNX #8681, cross-linked both. A standalone CPU reproducer imports no ModelOpt: both gs.export_onnx and onnx.helper.make_graph fail for one 2,147,483,650-byte initializer; 4 KiB controls and the large add().CopyFrom() construction pass. The workaround now links both issues and states the removal condition: minimum supported GraphSurgeon/ONNX versions must pass the real >2 GiB export regression without the guard, including nested graphs and external-data saving.
Graph traversal. Added the path type and iterator annotations. Each step is now (node position, graph attribute name); the root path is empty. The docstring states the node-order preservation assumption through copy/export. Stock GraphSurgeon 0.6.1 rejects a list of gs.Graph attributes (ValueError); its exporter handles a single gs.Graph attribute. Removed the speculative list branch instead of claiming unsupported GRAPHS coverage. Extended the existing production-exporter metadata regression with two-level nested If graphs, covering multiple path steps, four leaf graphs, weights and sequence/optional metadata.
File-output compatibility and boundary. Returning None for output_path is intentional to avoid materializing a protobuf byte string before external-data saving. All three production file-output calls (baseline, region and final model) ignore the return value; candidate profiling explicitly passes None and consumes bytes. The guide now states this boundary and migration for external callers that consumed the old file-output return bytes. The breaking change remains documented in CHANGELOG. Large file export does not imply large candidate profiling support.
Validation retained and rerun: 65 focused CPU tests pass, including the new nested cases and all prior caller-preservation, sidecar-safety and production-exporter metadata cases. Pre-commit and Linux-target mypy pass. The existing real >2 GiB regression is unchanged; subgraph, capture and autotune_file routes all pass with weight SHA checks, external-data saving and ONNX checker. Elapsed / peak process RSS: subgraph 36.332 s / 10.67 GiB; capture 19.056 s / 6.67 GiB; autotune_file 40.556 s / 8.67 GiB. Final source differs from the heavy-tested source only in upstream links/docstrings; executable AST equality was checked, and the final source passed the CPU suite again.
I also self-reviewed the full PR source diff and the changed tests/docs. No new blocking finding in that pass. This follow-up does not claim new full-model or TensorRT runtime results; repository CI for this new head remains separate from the previously green head.
Main synchronization: merged main 580ffff1cddb9b20a38b7434e6290654ebf96a8f in 0cd87ec. Retained both CHANGELOG entries and the upstream UTC import together with the overload import. The changed ONNX files were synchronized into the isolated validation overlay; all 65 focused tests pass again, with source hashes matched. No full upstream Torch/GPU suite rerun is claimed for this merge. Fresh repository CI and human review are still required for this head.

Thanks for addressing the earlier items: Variable.type is restored, the tests run in unit CI, and the other export call sites use the shared exporter. One small fix remains.
Needs action:
Use len(tensor.raw_data) instead of sys.getsizeof in save_onnx (inline).
No action needed:
I ran the new and touched unit tests at this head: 63 passed. Removing the tensor.type = original.type restore makes 8 of them fail, so they guard it.
I could not run the real >2 GiB cases or the TensorRT routes.

sys.getsizeof includes about 33 bytes of object overhead (1033 for a 1000-byte buffer), so tensors of 991-1023 bytes now go to the sidecar, while the old size_threshold=1024 kept them inline. Use the actual length.

What does this PR do?
Type of change: Bug fix.
ONNX preprocessing and INT4 RTN graph reconstruction fail when an individual initializer exceeds 2 GiB. GraphSurgeon's repeated-field copy serializes that TensorProto, which raises
google.protobuf.message.EncodeErrorbefore external-data saving can run.Export the graph structure first, then copy oversized initializers with
CopyFrom. Preserve nested graphs, custom INT4 dtype metadata, external-data metadata, and the caller's graph. Graphs without oversized dense initializers keep the existing export path.Usage
Autotuner
export_onnx(output_path=...)writes external-data files and returnsNone; omitoutput_pathto obtain bytes.
Sidecar-path follow-up
c637b3e55449: 51 focused utility/autotuner pytest cases passed. Pre-commit and Linux-target mypy passed.Production-exporter follow-up
7fa99257a51b: 10 targeted CPU cases passed with the actual ModelOpt exporter, covering sequence/optional metadata in flat/local/captured scopes, BF16 and constant outputs, external-data file output, and byte-return behavior. Reverting the two production fixes reproduces 7 failures. Related focused pytest: 113 passed, 1 unchanged baseline FP16 Gemm tolerance failure. Real >2 GiB initializer Autotune file export also passed, including SHA-256 equality, external-data saving and ONNX checker. The real-size regression was invoked through the isolated WSL harness; CPU tests used focused pytest with --noconftest. Pre-commit and Linux-target mypy passed. Full model quantization and TensorRT plugin inference were not rerun.Developer-review follow-up
8a801d367ae7: added four default-CI CPU regression cases with a 1 KiB threshold, real GraphSurgeon export, checker validation, and metadata assertions (flat, local subgraph, outer capture, explicit BF16 dtype). Real >2 GiB and full AWQ/INT8/FP8 model runs were not repeated for this revision.CodeRabbit follow-up
98f444e434bb: reran real >2 GiB regressions in isolated Ubuntu 24.04 WSL2. Linux-target mypy and the remaining pre-commit checks passed.Invoked the parameterized regression functions in an isolated Ubuntu 24.04 / WSL2 harness with real 2 GiB + 2 byte initializers: loading, RTN reconstruction, and nested subgraph export all passed. All three failed with
EncodeErroragainst the unpatched baseline.Verified a real FP16 initializer of 2,542,796,800 bytes: export, SHA-256 equality, external-data saving, and ONNX checker passed. The source weight cache was unchanged.
Fixed-route elapsed time / peak process RSS: load 42.5 s / 8.65 GiB; RTN 20.6 s / 8.66 GiB; nested subgraph 38.0 s / 10.65 GiB. The real initializer check took 35.1 s / 10.12 GiB.
Pre-commit checks passed; mypy passed with the Linux target platform. The default macOS mypy target encounters an unrelated existing
os.sched_getaffinitytyping error. The new heavy regression is marked manual. Full-model reruns used the previous PR head
0f8a23e6d412on GB300 Native/WSL and RTX4000 Native/WSL (Jenkins 712–715): 22 passed, 22 failed, 12 skipped. Qwen3.6-27B INT4 RTN quantization passed on GB300 Native and WSL. INT8/FP8 reached ONNX checker and failed on the undefinedpast_key_values.0.keygraph input instead of the original protobuf exception. Small-model coverage includes Qwen0.5B and Llama3B; remaining failures include unsupported LayerNormalization, CUDA kernel availability, and runtime benchmark errors. These runs do not claim the complete suite passes. Before your PR is "Ready for review"
CONTRIBUTING.md: N/A; no copied implementation or new dependency.Additional Information
